A notebook optimizes for exploration. A production service optimizes for repeatability. The transition between the two is where many machine learning projects become fragile: preprocessing is duplicated, features drift, model files are loaded differently, and the path from input to prediction is difficult to test.
The first useful boundary is a single inference path. Validation, preprocessing, model loading, and post-processing should be explicit and deterministic. Once that boundary exists, an API such as FastAPI can expose the model without embedding notebook state or hidden assumptions in the request handler.
Packaging matters because the environment is part of the model. Pin dependencies, make the entry point reproducible, isolate configuration, and containerize the service when the deployment target benefits from it. The goal is not more tooling; it is fewer unknowns between two runs of the same experiment.
Finally, measure the service, not only the model. Latency, throughput, error rates, input drift, and evaluation metrics form the operational feedback loop. The model may be the most visible artifact, but the software around it determines whether the system remains useful.
